Outline of Research at the Start

素粒子物理学は、理論的考察や実験によって素粒子に働く新しい物理的機構(新物理)を探索 することで物質・空間の起源を解明しようとする学問であり、高統計なデータをつかって自 然現象を精密に測定することで、成果をあげてきた。 急速に発展した深層学習を、高統計 と精密測定を背景にした素粒子物理に自由に応用できるように発展させ、新物理の探索感度 を向上させることが本研究の目的である。また、ドメイン知識を深層学習に本格的に取り入 れることで、「素粒子物理学+機械学習」という研究スタイルから、機械学習分野そのもの へのフィードバックが行えるような研究へと転換を目指す

Outline of Annual Research Achievements

理論側では、QCD事象の特徴であるパートンレベルの高エネルギー衝突(100GeV以上)とパートンシャワーとハドロン生成の間のfactorization に着目し, Particle transformer (ParT)の中核であるattention 構造を、異なる特性量の相関に限定したcross attention を中核とする深層学習模型を開発した。 また素粒子標準模型を超える物理の探索に重要な重いHiggsの崩壊過程解析に関して、包括的な深層学習模型の比較をおこなった。 さらにParticle Transformer(ParT) と同等の結果を出す、軽量なMLP模型を物理的な考察に立脚して複数提案した。3a 分類に効果のある特徴量を入力とするmodulate MLP模型, サブジェットとジェット構成粒子との間のcross attention としたMLPmixer に基づく軽量な模型についても、プレプリント投稿をおこなっている。実験については、基盤モデルを素粒子実験に応用する研究を行っている。ジェットの分類問題を比較的シンプルなTransformerと大規模なデータを用いて解析し、さらに転移学習を利用することで、様々な種類(b-tag, q/g-tag, top/W/Z)のジェット分類を行った。さらに、事象識別問題に適応し有効性を示すことができている。また、 信号事象が再現する物理モデルのパラメータ抽出にNormalzing flowを使うことを提案し、多次元のパラメータを持つ物理モデルに対しても有効である可能性を示すことができた。加速器シミュレーションの開発においては次元削減手法の改良を行ったVAEによる次元削減では、複数の加速器パラメータ間の相関を再現できなかったが、回帰ニューラルネットワークを基本とした次元削減方法により、加速器パラメータ間の相関も再現可能であることを示した。

Reason

また、cross attention 機構はネットワークが、より重要な相関に集中する上で極めて重要なメカニズムで汎用性が高く、CERN の data science シリーズで講演を行い非常に高井評価を得た。また、Boost 2023, 深層学習でも最難関のNeurIPS 2023のワークショップ
(ML and Physical Sciences Workshop)、コンピューティングの専門家の会議であるISGC2024で成果報告を行った。

Strategy for Future Research Activity

Cross attention 機構の更なる追求、量子計算を使った深層学習など、より広い課題について素粒子物理への応用を探求し、実験グループと協調して基盤モデルを追求し統計誤差評価方法についても検討する。計画班の成果が出始めているため、国内の実験、理論の研究者が参加する研究会を開催し、他の計画班の知見もいれつつ更なる発展を目指す。
